Statement

Let 𝒳\mathcal X be a nonempty set and let k ⁣:𝒳×𝒳→ℝk \colon \mathcal X \times \mathcal X \to \R be a positive-definite kernel with reproducing kernel Hilbert space HH and norm βˆ₯β‹…βˆ₯H\norm{\cdot}_H. Let x1,…,xnβˆˆπ’³x_1, \dots, x_n \in \mathcal X, let c ⁣:ℝn→ℝβˆͺ{∞}c \colon \R^n \to \R \cup \set{\infty} be any function, and let g ⁣:[0,∞)→ℝg \colon [0, \infty) \to \R be strictly increasing. Then every minimiser f∈Hf \in H of c(f(x1),…,f(xn))+g(βˆ₯fβˆ₯H)c(f(x_1), \dots, f(x_n)) + g(\norm{f}_H) has the form f=βˆ‘i=1nΞ±i k(β‹…,xi)f = \sum_{i=1}^{n} \alpha_i \, k(\cdot, x_i) for some real numbers Ξ±1,…,Ξ±n\alpha_1, \dots, \alpha_n.

Remarks

Proof idea: let VV be the span of k(β‹…,x1),…,k(β‹…,xn)k(\cdot, x_1), \dots, k(\cdot, x_n) in the Hilbert space HH, and write f=fV+fβŠ₯f = f_V + f_\perp with fV∈Vf_V \in V and fβŠ₯βŠ₯Vf_\perp \perp V. By the reproducing property f(xi)=⟨f,k(β‹…,xi)⟩H=fV(xi)f(x_i) = \langle f, k(\cdot, x_i) \rangle_H = f_V(x_i), so the first term only depends on fVf_V. Since βˆ₯fβˆ₯H2=βˆ₯fVβˆ₯H2+βˆ₯fβŠ₯βˆ₯H2\norm{f}_H^2 = \norm{f_V}_H^2 + \norm{f_\perp}_H^2 and gg is strictly increasing, any ff with fβŠ₯β‰ 0f_\perp \ne 0 is beaten by fVf_V. If gg is only nondecreasing, the same argument shows that, if a minimiser exists, some minimiser has this form.

Example: kernel ridge regression minimises 1nβˆ‘i=1n(yiβˆ’f(xi))2+Ξ»βˆ₯fβˆ₯H2\frac1n \sum_{i=1}^{n} (y_i - f(x_i))^2 + \lambda \norm{f}_H^2 with Ξ»>0\lambda > 0. By the theorem f=βˆ‘iΞ±ik(β‹…,xi)f = \sum_i \alpha_i k(\cdot, x_i), and with the Gram matrix Kij=k(xi,xj)K_{ij} = k(x_i, x_j) the problem becomes a quadratic problem in Ξ±βˆˆβ„n\alpha \in \R^n, solved by Ξ±=(K+nΞ»I)βˆ’1y\alpha = (K + n \lambda I)^{-1} y.

Without the penalty g(βˆ₯fβˆ₯H)g(\norm{f}_H) the conclusion fails: if HH is infinite-dimensional, adding to a minimiser any nonzero fβŠ₯βŠ₯Vf_\perp \perp V gives another minimiser of c(f(x1),…,f(xn))c(f(x_1), \dots, f(x_n)) that is not in VV.

Going deeper

For a student

The theorem is what makes kernel methods computable: support vector machines, kernel ridge regression and smoothing splines all reduce to finite-dimensional problems in Ξ±\alpha involving only the Gram matrix KK. It is a form of regularized empirical risk minimization in a reproducing kernel Hilbert space, where the penalty βˆ₯fβˆ₯H\norm{f}_H controls smoothness. The "kernel trick" follows: the solution can be evaluated at a new point xx as βˆ‘iΞ±ik(x,xi)\sum_i \alpha_i k(x, x_i) without ever working with elements of HH explicitly. Versions of the theorem allow an additional unpenalised finite-dimensional part, such as a constant term.
