Definition

Let 𝒯=[a,b]\mathcal T = [a, b] with a<ba < b, and let H=L2(𝒯)H = L^2(\mathcal T) be the Hilbert space of square-integrable real functions on 𝒯\mathcal T, with inner product ⟨f,g⟩=∫𝒯f(t)g(t) dt\langle f, g \rangle = \int_{\mathcal T} f(t) g(t) \, dt. Functional data analysis is the statistical analysis of data X1,…,XnX_1, \dots, X_n that are realisations of a random element XX of HH. Such an XX is a stochastic process (X(t))t∈𝒯(X(t))_{t \in \mathcal T} with paths in HH. Its basic parameters, when E∥X∥2<∞E\norm{X}^2 < \infty, are:

  1. the mean function μ(t)=E[X(t)]\mu(t) = E[X(t)], an expected value for each tt;
  2. the covariance function C(s,t)=Cov⁡(X(s),X(t))C(s, t) = \operatorname{Cov}(X(s), X(t));
  3. the covariance operator 𝒞 ⁣:H→H\mathcal C \colon H \to H, (𝒞f)(t)=∫𝒯C(s,t)f(s) ds(\mathcal C f)(t) = \int_{\mathcal T} C(s, t) f(s) \, ds.

Remarks

The operator 𝒞\mathcal C is compact, self-adjoint and positive semidefinite, so it has an orthonormal basis of eigenfunctions ϕk\phi_k with eigenvalues λ1≥λ2≥⋯≥0\lambda_1 \ge \lambda_2 \ge \dots \ge 0. Functional principal component analysis estimates these and writes X=μ+∑kξkϕkX = \mu + \sum_k \xi_k \phi_k with uncorrelated scores ξk=⟨X−μ,ϕk⟩\xi_k = \langle X - \mu, \phi_k \rangle of variance λk\lambda_k. The sample versions are μ^=1n∑iXi\hat\mu = \frac1n \sum_i X_i and C^(s,t)=1n∑i(Xi(s)−μ^(s))(Xi(t)−μ^(t))\hat C(s, t) = \frac1n \sum_i (X_i(s) - \hat\mu(s))(X_i(t) - \hat\mu(t)).

Example: let X(t)=ξ2sin⁡(πt)X(t) = \xi \sqrt{2} \sin(\pi t) on [0,1][0, 1], with ξ\xi a real random variable of mean 00 and variance 11. Then μ=0\mu = 0 and C(s,t)=2sin⁡(πs)sin⁡(πt)C(s, t) = 2 \sin(\pi s) \sin(\pi t), so 𝒞\mathcal C has the single nonzero eigenvalue 11, with eigenfunction 2sin⁡(πt)\sqrt{2} \sin(\pi t) of norm 11.

Non-example: a table of the heights of children measured once each, at a single age, is ordinary multivariate data, not functional data, since no observation is a function of tt.
