Kernel density estimation

Builds on Probability density functionIndependent and identically distributed random variables

Definition

Let X1,…,XnX_1, \dots, X_n be i.i.d. real random variables with an unknown probability density function ff. Let K ⁣:ℝ→ℝK \colon \R \to \R be an integrable function with ∫ℝK(u) du=1\int_{\R} K(u) \, du = 1, called the kernel, and let h>0h > 0, called the bandwidth. The kernel density estimator of ff is f^h(x)=1nh∑i=1nK(x−Xih),x∈ℝ.\hat f_h(x) = \frac{1}{n h} \sum_{i=1}^{n} K\Big(\frac{x - X_i}{h}\Big), \quad x \in \R.

Remarks

The substitution u=(x−Xi)/hu = (x - X_i)/h gives ∫ℝf^h(x) dx=1\int_{\R} \hat f_h(x) \, dx = 1; if moreover K≥0K \ge 0, then f^h\hat f_h is a probability density. Common kernels are the Gaussian kernel K(u)=e−u2/2/2πK(u) = e^{-u^2/2}/\sqrt{2\pi} and the Epanechnikov kernel K(u)=34(1−u2)K(u) = \frac{3}{4}(1 - u^2) for ∣u∣≤1\abs{u} \le 1, 00 otherwise. Example: with K=12𝟏[−1,1]K = \frac{1}{2} \mathbf{1}_{[-1, 1]}, f^h(x)\hat f_h(x) is the fraction of data in [x−h,x+h][x - h, x + h] divided by 2h2h. Non-example: K=𝟏[−1,1]K = \mathbf{1}_{[-1, 1]} has integral 22, so the resulting f^h\hat f_h integrates to 22 and is not a density estimate. If ff is twice continuously differentiable and KK is a bounded symmetric density with finite variance, the mean integrated squared error is smallest for hh of order n−1/5n^{-1/5}. In ℝd\R^d, one uses 1nhd∑iK((x−Xi)/h)\frac{1}{n h^d} \sum_i K((x - X_i)/h) with a kernel on ℝd\R^d.
