Statement

Let AA be a real symmetric positive definite n×nn \times n matrix, let b∈ℝnb \in \R^n, let x∗=A−1bx^* = A^{-1} b, and let x0∈ℝnx_0 \in \R^n. Write ∥v∥A=vTAv\norm{v}_A = \sqrt{v^T A v} and r(x)=b−Axr(x) = b - A x.

  1. (Conjugate directions) Let p0,…,pm−1p_0, \dots, p_{m-1} be nonzero vectors with piTApj=0p_i^T A p_j = 0 for i≠ji \ne j. Define xk+1=xk+αkpkx_{k+1} = x_k + \alpha_k p_k with αk=pkTr(xk)/pkTApk\alpha_k = p_k^T r(x_k) / p_k^T A p_k. Then for each k≤mk \le m, the residual r(xk)r(x_k) is orthogonal to p0,…,pk−1p_0, \dots, p_{k-1}. Moreover xkx_k minimizes ∥x−x∗∥A\norm{x - x^*}_A over x0+span⁡{p0,…,pk−1}x_0 + \operatorname{span} \set{p_0, \dots, p_{k-1}}. If m=nm = n, then xn=x∗x_n = x^*.
  2. (Short recurrence) Let rk=r(xk)r_k = r(x_k), and suppose r0,…,rkr_0, \dots, r_k are nonzero. Let the directions arise by AA-orthogonalizing the residuals. That is, p0=r0p_0 = r_0, and pkp_k is rkr_k minus its AA-orthogonal projection onto span⁡{p0,…,pk−1}\operatorname{span} \set{p_0, \dots, p_{k-1}}. Then span⁡{p0,…,pk−1}=𝒦k(A,r0)\operatorname{span} \set{p_0, \dots, p_{k-1}} = \mathcal{K}_k(A, r_0), and pk=rk+βk−1pk−1p_k = r_k + \beta_{k-1} p_{k-1} with βk−1=rkTrk/rk−1Trk−1\beta_{k-1} = r_k^T r_k / r_{k-1}^T r_{k-1}. Also αk=rkTrk/pkTApk\alpha_k = r_k^T r_k / p_k^T A p_k.

Remarks

For clause 1, the function f(x)=12∥x−x∗∥A2f(x) = \frac12 \norm{x - x^*}_A^2 restricted to x0+span⁡{p0,…,pk−1}x_0 + \operatorname{span}\set{p_0, \dots, p_{k-1}} separates into one quadratic in each coordinate, by conjugacy. The step αk\alpha_k minimizes the quadratic in the kk-th coordinate, and later steps do not change the earlier coordinates. For clause 2, the residual rkr_k is orthogonal to 𝒦k(A,r0)\mathcal{K}_k(A, r_0) by clause 1. Since Apj∈𝒦j+2(A,r0)A p_j \in \mathcal{K}_{j+2}(A, r_0), the vector rkr_k is AA-orthogonal to pjp_j for j<k−1j < k - 1. So only the last direction enters the Gram–Schmidt step, and this gives the two-term recurrence. Clause 2 with clause 1 is exactly the conjugate gradient method. Example: with pi=eip_i = e_i and AA diagonal, the directions are conjugate, and the method of clause 1 solves the ii-th equation at step ii.

For a student

There is a second derivation from the Lanczos algorithm. The Arnoldi iteration applied to a symmetric AA gives an orthonormal basis of 𝒦k(A,r0)\mathcal{K}_k(A, r_0) in which AA becomes a tridiagonal matrix TkT_k. The Galerkin condition rk⊥𝒦k(A,r0)r_k \perp \mathcal{K}_k(A, r_0) asks to solve a system with TkT_k. Updating an LDLTL D L^T factorization of TkT_k step by step gives the same recurrences. This view explains the link between conjugate gradients and the Lanczos process for eigenvalues.
