Definition

Let X1,…,XnX_1, \dots, X_n be observations with values in a set 𝒳\mathcal{X}, and let Θ\Theta be a parameter set. Let ρ ⁣:𝒳×Θ→ℝ\rho \colon \mathcal{X} \times \Theta \to \R be a function. An M-estimator with loss ρ\rho is an estimator θ^n\hat{\theta}_n that minimizes θ↦∑i=1nρ(Xi,θ)\theta \mapsto \sum_{i=1}^n \rho(X_i, \theta) over Θ\Theta.

Remarks

When Θ⊆ℝk\Theta \subseteq \R^k is open and ρ\rho is differentiable in θ\theta with gradient ψ(x,θ)=∇θρ(x,θ)\psi(x, \theta) = \nabla_\theta \rho(x, \theta), an interior minimizer solves ∑i=1nψ(Xi,θ)=0\sum_{i=1}^n \psi(X_i, \theta) = 0. An estimator defined as a root of such an equation, for a given function ψ\psi, is also called an M-estimator (of ψ\psi-type), or a Z-estimator.

Example: with ρ(x,θ)=(x−θ)2\rho(x, \theta) = (x - \theta)^2 on ℝ\R, the sum is minimized at the sample mean, since its derivative −2∑i(Xi−θ)-2\sum_i (X_i - \theta) vanishes only at θ=Xˉ\theta = \bar{X}. With ρ(x,θ)=∣x−θ∣\rho(x, \theta) = \abs{x - \theta}, the minimizers are the sample medians. With ρ(x,θ)=−log⁡f(x;θ)\rho(x, \theta) = -\log f(x; \theta) for a family of densities, the M-estimator is the maximum likelihood estimator.

Non-example: the midrange (min⁡iXi+max⁡iXi)/2(\min_i X_i + \max_i X_i)/2 minimizes max⁡i∣Xi−θ∣\max_i \abs{X_i - \theta}, a maximum over the observations rather than a sum of terms ρ(Xi,θ)\rho(X_i, \theta), so this description does not exhibit it as an M-estimator.

Under regularity conditions, n(θ^n−θ0)\sqrt{n}(\hat{\theta}_n - \theta_0) is asymptotically normal with the sandwich covariance A−1BA−TA^{-1} B A^{-T}, where A=E[∇θψ(X,θ0)]A = E[\nabla_\theta \psi(X, \theta_0)] and B=E[ψ(X,θ0)ψ(X,θ0)T]B = E[\psi(X, \theta_0)\psi(X, \theta_0)^T], and θ0\theta_0 minimizes E[ρ(X,θ)]E[\rho(X, \theta)].
