Definition

Robust statistics is the study of statistical procedures that remain reliable when the true distribution of the data is only close to the assumed model. The basic precise notion is Hampel's qualitative robustness. Let X1,X2,…X_1, X_2, \dots be i.i.d. real random variables with distribution FF, and let Tn=Tn(X1,…,Xn)T_n = T_n(X_1, \dots, X_n), n≥1n \ge 1, be a sequence of estimators. Write ℒF(Tn)\mathcal{L}_F(T_n) for the law of TnT_n when the XiX_i have distribution FF, and let π\pi be the Lévy–Prokhorov metric on probability distributions. The sequence (Tn)(T_n) is qualitatively robust at FF if for every ε>0\varepsilon > 0 there is δ>0\delta > 0 such that for every distribution GG and every nn, π(F,G)<δ  ⟹  π(ℒF(Tn),ℒG(Tn))<ε.\pi(F, G) < \delta \implies \pi\big(\mathcal{L}_F(T_n), \mathcal{L}_G(T_n)\big) < \varepsilon.

Remarks

Qualitative robustness asks that the maps G↦ℒG(Tn)G \mapsto \mathcal{L}_G(T_n) be continuous at FF, uniformly in nn. Closeness in π\pi allows both small rounding of all data and a small fraction of arbitrary outliers. The quantitative measures are the breakdown point and the influence function.

Example: if FF has a unique median mm, the sample median is qualitatively robust at FF. A small fraction of outliers can shift it only to nearby order statistics, so its law changes little.

Non-example: the sample mean is not qualitatively robust at any FF. Let 0<η<δ0 < \eta < \delta and G=(1−η)F+η δxG = (1 - \eta) F + \eta \, \delta_x, with δx\delta_x the point mass at xx; then π(F,G)≤η<δ\pi(F, G) \le \eta < \delta. For large nn, with high probability about nηn\eta observations equal xx, and the mean moves by about ηx\eta x, which is arbitrarily large for large xx.
