Bayesian hierarchical model

Builds on Parametric modelPrior probabilityPosterior probabilityBayes' theorem

Definition

A Bayesian hierarchical model (with two levels of prior) consists of the following.

  1. A parametric model for the data: given a parameter θ∈Θ\theta \in \Theta, the data xx have density f(x∣θ)f(x \mid \theta).
  2. A prior for θ\theta that depends on a hyperparameter φ∈Φ\varphi \in \Phi: given φ\varphi, the parameter θ\theta has density π(θ∣φ)\pi(\theta \mid \varphi).
  3. A hyperprior: a probability distribution on Φ\Phi with density π(φ)\pi(\varphi).

The joint density of (x,θ,φ)(x, \theta, \varphi) is f(x∣θ) π(θ∣φ) π(φ)f(x \mid \theta)\,\pi(\theta \mid \varphi)\,\pi(\varphi), and the posterior of (θ,φ)(\theta, \varphi) given xx is proportional to it, by Bayes' theorem.

Remarks

Models with more levels add further hyperpriors in the same way. Example: data in JJ groups with Xij∣θj∼𝒩(θj,σ2)X_{ij} \mid \theta_j \sim \mathcal{N}(\theta_j, \sigma^2), group means θj∣μ,τ∼𝒩(μ,τ2)\theta_j \mid \mu, \tau \sim \mathcal{N}(\mu, \tau^2) i.i.d., and a hyperprior on (μ,τ)(\mu, \tau). All three clauses hold, with θ=(θ1,…,θJ)\theta = (\theta_1, \dots, \theta_J) and φ=(μ,τ)\varphi = (\mu, \tau). Given μ\mu and τ\tau, the posterior mean of each θj\theta_j lies between the sample mean of group jj and the overall level μ\mu. Non-example: the same model with μ\mu and τ\tau fixed numbers has no hyperprior, so clause 3 fails; it is an ordinary one-level Bayesian model. Integrating out θ\theta gives the marginal ∫f(x∣θ)π(θ∣φ) dθ\int f(x \mid \theta)\pi(\theta \mid \varphi)\,d\theta; estimating φ\varphi from it instead of using a hyperprior is the empirical Bayes approach.
