Smoothing spline

Builds on Cubic splineLeast squaresSecond derivative

Definition

Let n≥2n \ge 2, let a≤x1<x2<⋯<xn≤ba \le x_1 < x_2 < \cdots < x_n \le b be real nodes, let y1,…,yny_1, \dots, y_n be real numbers, and let λ>0\lambda > 0. Let WW be the space of functions f ⁣:[a,b]→ℝf \colon [a, b] \to \R such that f′f' is absolutely continuous and f′′f'' is square integrable. The smoothing spline for these data is the function f∈Wf \in W that minimizes Jλ(f)=∑i=1n(yi−f(xi))2+λ∫abf′′(x)2 dx.J_\lambda(f) = \sum_{i=1}^{n} \big(y_i - f(x_i)\big)^2 + \lambda \int_a^b f''(x)^2 \, dx.

Remarks

The minimizer exists and is unique, and it is a natural cubic spline with knots x1,…,xnx_1, \dots, x_n: a cubic on each [xi,xi+1][x_i, x_{i+1}], of class C2C^2, and linear on [a,x1][a, x_1] and [xn,b][x_n, b]. Uniqueness uses n≥2n \ge 2: then a function with f′′=0f'' = 0 that vanishes at all nodes is zero. Example: if the data lie on a line, yi=α+βxiy_i = \alpha + \beta x_i, then f(x)=α+βxf(x) = \alpha + \beta x gives Jλ(f)=0J_\lambda(f) = 0, so it is the smoothing spline for every λ\lambda. Non-example: take n≥3n \ge 3 data not on a line, and let gg be the natural cubic spline through them. Its second derivative penalty is positive, and moving gg slightly toward a line lowers JλJ_\lambda, so gg is not the minimizer. As λ→0\lambda \to 0 the smoothing spline tends to the natural interpolating cubic spline, and as λ→∞\lambda \to \infty it tends to the least squares regression line. In practice λ\lambda is often chosen by generalized cross-validation.
